Challenges in integrating CI/CD pipelines for machine learning workflows

Post by FraneWatson »

I’ve been struggling lately to properly integrate CI/CD pipelines into our ML workflow. Regular software pipelines are straightforward enough, but when you throw in data versioning, model retraining, and dependency drift, everything becomes a mess. We tried using GitHub Actions and MLflow, but the setup feels fragile — especially when models need retraining on new data. Curious if anyone has managed to build something stable without spending weeks on YAML files and broken builds?

Totally hear you on that. Integrating CI/CD for ML isn’t as plug-and-play as it is for standard software dev. In my team, we faced similar issues — data version mismatches, flaky environments, and slow model validation stages that broke the whole flow. What helped was rethinking CI/CD around the data lifecycle instead of just the code. We ended up getting some guidance from mlops managed services — their approach focuses on decoupling data validation from model deployment, using containerized test environments and modular triggers for retraining. Once we separated the data drift checks and automated artifact promotion, the pipeline stabilized a lot. You might want to experiment with staged pipelines and smaller, isolated triggers instead of one giant workflow.

That’s actually a great point about splitting the workflow. We’ve been guilty of overloading a single pipeline too. Adding data checks and model validation as separate stages sounds like a clean idea. I’ll give that modular approach a try; it sounds less brittle than our current setup.
